A New Shield for Federated Learning: Balancing Privacy, Robustness, and Speed

A novel scheme for federated learning tackles the critical trade-off between privacy, Byzantine robustness, and computational efficiency. The approach integrates homomorphic encryption with a dimension compression technique based on the Johnson-Lindenstrauss transformation. Using a dual-server architecture, it enables secure Byzantine defense on encrypted data while dramatically reducing overhead by compressing gradient updates. This method preserves the geometric relationships needed for security, slashing computational complexity from O(dn) to O(kn) operations where k is much smaller than d. Extensive testing shows the system maintains model accuracy comparable to standard federated learning while defending against networks where up to 40% of clients are malicious.

Study Significance: For cybersecurity professionals focused on secure machine learning and threat intelligence, this research provides a practical path to deploy large-scale, privacy-preserving federated learning. The order-of-magnitude gains in computational and communication efficiency directly address a major barrier to implementing robust encryption and intrusion prevention in real-world systems. This advancement could reshape secure protocol design for collaborative AI, making it feasible to train complex models on sensitive data across distributed and potentially untrusted endpoints without compromising on security or performance.
